Can't change bluetooth speaker volume from windows

I'm 99% sure this has always worked. For some reason, the volume controls in Windows 10 do not change the volume coming out of my bluetooth speaker. This is incredibly inconvenient. What sort of solutions are there for this? The bluetooth and audio drivers are already up to date, same with Windows.
