It keeps turning off randomly when playing some games although never from browsing the internet or watching videos. At first I assumed it was due to my CPU overheating (i only had a stock cooler) but I've replaced the cooler with a fairly high end cooler so it should be fine temp-wise.

Is it just a PSU problem or should I rule out other parts before I buy a new PSU?

I've had this exact same issue. PC would randomly restart while playing games. At first, it would happen once every 2 weeks, but after a few weeks, the severity increased and the PC would reboot even if it was on idle. Turned out, it was the PSU that was causing troubles. I had a VS550 which I replaced with a S12ii 620w and I haven't faced this issue since.
